The planning team has a sophisticated model. It accounts for seasonality, promotions, regional variance, and apparently the phase of the moon (I am not making this up). It feeds into a beautiful dashboard that stakeholders look at and nod approvingly.
The model is wrong roughly 40% of the time and everyone has agreed, silently, not to bring this up in meetings.
Here is the uncomfortable reality of demand forecasting: most organizations have a model problem that is actually a data problem wearing a lab coat. The forecast is not failing because you need a better algorithm. It is failing because the inputs are stale, inconsistent, or quietly incorrect in ways that took six months to even notice.
What the Model Is Actually Eating
A demand forecast is only as good as the signals it ingests. And those signals typically include:
- Historical sales data that has been cleaned by three different teams in three different ways
- Promotional calendars that were updated in the planning tool but not in the data pipeline
- External signals like weather, events, or trends that someone added once, in a spreadsheet, and has been manually refreshing ever since
- Inventory availability data that is running 24 to 48 hours behind actual warehouse state
Put differently: you are feeding yesterday's news into today's model and wondering why it keeps getting tomorrow wrong.
Why ML Does Not Fix This By Default
There is a popular belief that if you throw enough machine learning at a demand signal, eventually the model will learn to compensate for data gaps. This is approximately as reliable as assuming noise-canceling headphones will also cancel your colleague's cologne.
ML models are very good at finding patterns. They are also very good at finding patterns in garbage, and confidently reporting those patterns as insights. GIGO, garbage in, garbage out, was coined in 1957 and we have collectively learned nothing from it.
The models that actually perform well in demand forecasting share one characteristic: someone upstream spent a genuinely uncomfortable amount of time on the data pipeline before anyone touched the model configuration. Not a heroic one-time cleanse, but ongoing data quality monitoring, automated anomaly detection on input signals, and a clear lineage from source system to model input.
That is the unsexy part nobody wants to fund.
Where AI Actually Helps
The AI story in demand forecasting is not "replace your planner with a model." It is subtler than that and more useful:
Anomaly detection on input signals. Train a lightweight model to flag when a data feed looks wrong before it poisons your forecast. A spike in sales that correlates with a known promotion is fine. A spike that correlates with nothing is probably a pipeline error.
Automated feature engineering. ML models can surface which external signals correlate with your product category without a data scientist manually hypothesizing each one. You do not always know in advance that a competitor's stockout drives your numbers up for three weeks.
Confidence-weighted outputs. Instead of a single point forecast, give planners a range with explicit uncertainty attached. If the model has low confidence because the input data is patchy, say so. A planner who knows the forecast is uncertain will plan differently than one who trusts a false precision.
Explainability by default. This one is underrated. A planner who cannot understand why the model recommended a particular number will override it. Every time. AI that explains its reasoning gets adopted. AI that does not gets replaced by a spreadsheet, which will happen faster than you expect.
The Real Problem Is Organizational
Demand forecasting spans multiple teams. Sales owns the promotional calendar. Operations owns the inventory signal. Finance owns the planning tool. IT owns the pipelines. And nobody owns the gap between all of them.
AI is not going to fix a coordination problem. It is going to make the coordination problem more expensive and slightly more automated.
The organizations that get this right have someone, usually with an uncomfortable job title like "head of integrated planning data," who owns end-to-end signal quality. Not the model. The signal. Everything else follows from there.
The Short Version
Your demand forecast is failing at the data layer, not the model layer. Better AI will not help until the inputs are trustworthy. Get the data right, then throw interesting algorithms at it. Not the other way around.
It is not a glamorous message. But neither is a forecast that misses by 40%.
